Training a model for image-to-image translation typically requires a large dataset of paired examples.

These datasets can be difficult and expensive to prepare, and in some cases impossible, such as photographs of paintings by long dead artists. The CycleGAN is a technique that involves the automatic training of image-to-image translation models without paired examples.

The models are trained in an unsupervised manner using a collection of images from the source and target domain that do not need to be related in any way. This simple technique is powerful, achieving visually impressive results on a range of application domains, most notably translating photographs of horses to zebra, and the reverse.

Image-to-image translation is an image synthesis task that requires the generation of a new image that is a controlled modification of a given image.

Image-to-image translation is a class of vision and graphics problems where the goal is to learn the mapping between an input image and an output image using a training set of aligned image pairs.

Traditionally, training an image-to-image translation model requires a dataset comprised of paired examples. That is, a large dataset of many examples of input images X e. The requirement for a paired training dataset is a limitation.

These datasets are challenging and expensive to prepare, e. In many cases, the datasets simply do not exist, such as famous paintings and their respective photographs. However, obtaining paired training data can be difficult and expensive. For many tasks, like object transfiguration e. As such, there is a desire for techniques for training an image-to-image translation system that does not require paired examples.

Specifically, where any two collections of unrelated images can be used and the general characteristics extracted from each collection and used in the image translation process. For example, to be able to take a large collection of photos of summer landscapes and a large collection of photos of winter landscapes with unrelated scenes and locations as the first location and be able to translate specific photos from one group to the other.

CycleGAN is an approach to training image-to-image translation models using the generative adversarial network, or GAN, model architecture. The GAN architecture is an approach to training a model for image synthesis that is comprised of two models: a generator model and a discriminator model.GitHub is home to over 40 million developers working together to host and review code, manage projects, and build software together.

We will train a generative adversarial network GAN to generate new celebrities after showing it pictures of many real celebrities. Also, for the sake of time it will help to have a GPU, or two. Lets start from the beginning. They are made of two distinct models, a generator and a discriminator.

The job of the discriminator is to look at an image and output whether or not it is a real training image or a fake image from the generator. During training, the generator is constantly trying to outsmart the discriminator by generating better and better fakes, while the discriminator is working to become a better detective and correctly classify the real and fake images.

Now, lets define some notation to be used throughout tutorial starting with the discriminator. From the paper, the GAN loss function is. However, the convergence theory of GANs is still being actively researched and in reality models do not always train to this point.

A DCGAN is a direct extension of the GAN described above, except that it explicitly uses convolutional and convolutional-transpose layers in the discriminator and generator, respectively. It was first described by Radford et. The discriminator is made up of strided convolution layers, batch norm layers, and LeakyReLU activations. The input is a 3x64x64 input image and the output is a scalar probability that the input is from the real data distribution.

The generator is comprised of convolutional-transpose layers, batch norm layers, and ReLU activations.

The strided conv-transpose layers allow the latent vector to be transformed into a volume with the same shape as an image. In the paper, the authors also give some tips about how to setup the optimizers, how to calculate the loss functions, and how to initialize the model weights, all of which will be explained in the coming sections.

In this tutorial we will use the Celeb-A Faces dataset which can be downloaded at the linked site, or in Google Drive. Once downloaded, create a directory named celeba and extract the zip file into that directory. Then, set the dataroot input for this notebook to the celeba directory you just created. The resulting directory structure should be:. Now, we can create the dataset, create the dataloader, set the device to run on, and finally visualize some of the training data.GitHub is home to over 40 million developers working together to host and review code, manage projects, and build software together.

This notebook assumes you are familiar with Pix2Pix, which you can learn about in the Pix2Pix tutorial.

The code for CycleGAN is similar, the main difference is an additional loss function, and the use of unpaired training data. CycleGAN uses a cycle consistency loss to enable training without the need for paired data. In other words, it can translate from one domain to another without a one-to-one mapping between the source and target domain. This opens up the possibility to do a lot of interesting tasks like photo-enhancement, image colorization, style transfer, etc.

All you need is the source and the target dataset which is simply a directory of images. This tutorial trains a model to translate from images of horses, to images of zebras.

You can find this dataset and similar ones here. As mentioned in the paperapply random jittering and mirroring to the training dataset. These are some of the image augmentation techniques that avoids overfitting. This is similar to what was done in pix2pix. The model architecture used in this tutorial is very similar to what was used in pix2pix.

Some of the differences are:. In CycleGAN, there is no paired data to train on, hence there is no guarantee that the input x and the target y pair are meaningful during training.

Thus in order to enforce that the network learns the correct mapping, the authors propose the cycle consistency loss. The discriminator loss and the generator loss are similar to the ones used in pix2pix.

Deep Learning 47: TensorFlow Implementation of Image to Image Translation Network (Cycle GAN)

Cycle consistency means the result should be close to the original input. For example, if one translates a sentence from English to French, and then translates it back from French to English, then the resulting sentence should be the same as the original sentence. This tutorial has shown how to implement CycleGAN starting from the generator and discriminator implemented in the Pix2Pix tutorial. As a next step, you could try using a different dataset from TensorFlow Datasets.

You could also train for a larger number of epochs to improve the results, or you could implement the modified ResNet generator used in the paper instead of the U-Net generator used here.
